Pengembangan Denoising Adaptif Berbasis Local Variance Thresholding dan Arsitektur Multilevel Wavelet CNN-BiLSTM untuk Klasifikasi dan Peramalan

Perkembangan komputasi statistika telah mendorong pemanfaatan metode berbasis signal processing dan deep learning dalam berbagai bidang analisis data. Data empiris yang diperoleh melalui proses pengukuran dan observasi dapat mengalami kontaminasi noise selama proses akuisisi, yang bersumber dari lingkungan, karakteristik instrumen, maupun mekanisme pengukuran. Keberadaan noise tersebut dapat menurunkan kualitas representasi fitur serta kinerja model, sehingga proses denoising menjadi tahap penting dalam preprocessing sebelum data dianalisis lebih lanjut menggunakan model deep learning. Selain kebutuhan untuk mereduksi noise, proses analisis juga perlu mempertimbangkan karakteristik data yang beragam, seperti perbedaan representasi satu dimensi (1D) dan dua dimensi (2D) serta adanya pola temporal pada data berurutan. Karakteristik tersebut mendorong kebutuhan akan suatu kerangka pemodelan yang mampu mengakomodasi representasi multiresolusi, ekstraksi fitur, dan pemodelan dependensi temporal. Penelitian ini mengembangkan model Multilevel Wavelet CNN-BiLSTM yang mengintegrasikan dekomposisi multilevel wavelet, CNN, dan BiLSTM dalam satu alur pemodelan. Dekomposisi multilevel wavelet digunakan sebagai tahap awal pemrosesan, CNN digunakan untuk ekstraksi fitur, sedangkan BiLSTM digunakan untuk menangkap dependensi temporal. Kerangka tersebut dievaluasi pada data dengan representasi 1D dan 2D melalui dua eksperimen, yaitu peramalan data time series dan klasifikasi citra medis. Hasil evaluasi menunjukkan bahwa kerangka yang dikembangkan memberikan kinerja yang kompetitif dibandingkan pendekatan pembanding pada sebagian besar studi kasus. Hasil tersebut juga menunjukkan adanya ruang pengembangan pada aspek denoising, khususnya melalui pemanfaatan karakteristik lokal koefisien wavelet.
Berdasarkan kebutuhan tersebut, penelitian selanjutnya difokuskan pada pengembangan mekanisme denoising adaptif. Metode denoising berbasis soft dan hard thresholding memiliki karakteristik shrinkage yang berbeda, dengan masing-masing menggunakan satu jenis operator thresholding pada koefisien yang diproses. Hasil kajian literatur menunjukkan bahwa berbagai pendekatan adaptif telah dikembangkan dengan menyesuaikan nilai threshold berdasarkan karakteristik koefisien dan informasi lokal, seperti level wavelet, subband, statistik koefisien, dan variansi lokal. Meskipun demikian, informasi lokal tersebut pada umumnya dimanfaatkan untuk menentukan nilai threshold atau parameter shrinkage, sehingga terdapat ruang pengembangan lebih lanjut untuk memanfaatkannya sebagai dasar dalam pemilihan operator thresholding.
Kontribusi utama penelitian ini adalah pengembangan Local Variance Thresholding (LVT) pada multilevel wavelet transform sebagai pendekatan denoising adaptif. LVT menggunakan variansi lokal koefisien wavelet sebagai dasar untuk memilih secara adaptif antara soft dan hard thresholding pada berbagai tingkat dekomposisi. Mekanisme tersebut menyesuaikan pemilihan operator thresholding berdasarkan karakteristik lokal koefisien, sehingga dapat mereduksi noise sekaligus mempertahankan informasi penting dalam data. Metode LVT dievaluasi pada dua bentuk representasi data, yaitu representasi 1D melalui klasifikasi sinyal biomedis PPG dan representasi 2D melalui klasifikasi citra medis. Hasil eksperimen menunjukkan bahwa kombinasi LVT dan CNN meningkatkan kualitas sinyal yang ditunjukkan oleh nilai SNR yang lebih tinggi serta memberikan peningkatan kinerja klasifikasi dibandingkan pendekatan lain. Penelitian ini membentuk rangkaian pengembangan yang dimulai dari pengembangan dan evaluasi kerangka Multilevel Wavelet CNN-BiLSTM, dilanjutkan dengan identifikasi kebutuhan untuk meningkatkan kemampuan denoising, dan menghasilkan pengembangan LVT sebagai mekanisme denoising adaptif. Kedua pendekatan tersebut dikembangkan dan dievaluasi secara independen melalui empat eksperimen.
The advancement of statistical computing has driven the adoption of methods based on signal processing and deep learning across various fields of data analysis. Empirical data obtained through measurement and observation processes may be contaminated by noise during data acquisition, originating from environmental conditions, instrument characteristics, and measurement mechanisms. The presence of such noise can degrade feature representation quality and model performance, making denoising an important preprocessing step prior to further analysis using deep learning models. Beyond the need to mitigate noise, the analysis must also account for heterogeneous data characteristics, including differences between one-dimensional (1D) and two-dimensional (2D) representations and the presence of temporal patterns in sequential data. These characteristics necessitate a modeling framework capable of accommodating multiresolution representations, feature extraction, and temporal dependency modeling.
This study develops a Multilevel Wavelet CNN-BiLSTM model that integrates multilevel wavelet decomposition, CNN, and BiLSTM within a unified modeling framework. Multilevel wavelet decomposition is employed as the initial processing stage, CNN is used for feature extraction, and BiLSTM is employed to capture temporal dependencies. The proposed framework is evaluated on both 1D and 2D data representations through two experiments involving time-series forecasting and medical image classification. The evaluation results demonstrate that the proposed framework achieves competitive performance compared with benchmark approaches across most case studies. The findings also indicate an opportunity for further improvement in denoising, particularly through the utilization of local characteristics of wavelet coefficients.
Motivated by this requirement, the subsequent investigation focuses on the development of an adaptive denoising mechanism. Soft and hard thresholding methods exhibit distinct shrinkage characteristics, with each applying a single thresholding operator to the coefficients being processed. A review of the literature indicates that various adaptive approaches have been developed by adjusting threshold values according to coefficient characteristics and local information, including wavelet levels, subbands, coefficient statistics, and local variance. However, such local information has predominantly been utilized to determine threshold values or shrinkage parameters, leaving an opportunity to exploit local characteristics as a basis for selecting the thresholding operator itself.
The main contribution of this study is the development of Local Variance Thresholding (LVT) within the multilevel wavelet transform as an adaptive denoising approach. LVT uses the local variance of wavelet coefficients to adaptively select between soft and hard thresholding across different decomposition levels. This mechanism determines the thresholding operator according to the local characteristics of the coefficients, thereby enabling noise reduction while preserving essential information in the data. The LVT method is evaluated using two data representations: 1D representation through biomedical PPG signal classification and 2D representation through medical image classification. Experimental results demonstrate that the combination of LVT and CNN improves signal quality, as indicated by higher SNR values, while also enhancing classification performance compared with alternative approaches. Overall, this study comprises a systematic development process beginning with the development and evaluation of the Multilevel Wavelet CNN-BiLSTM framework, followed by the identification of denoising enhancement requirements, and culminating in the development of LVT as an adaptive denoising mechanism. The two approaches are developed and evaluated independently through four experiments.
