Pemodelan Pola Normal Heterogen Struktural Dan Temporal Untuk Data Getaran Pompa Industri

Pada sistem industri, data yang merepresentasikan kondisi anomali umumnya langka dan tidak berlabel. Kondisi tersebut mendorong penggunaan pendekatan pemodelan normalitas, yaitu mempelajari karakteristik data pada kondisi operasi normal dan memperlakukan penyimpangan terhadapnya sebagai indikasi anomali. Metode deep learning untuk pemodelan normalitas pada multivariate time series umumnya memodelkan seluruh variabel masukan menggunakan satu model prediksi. Pendekatan terbaru seperti HNAD mengatasi heterogenitas temporal melalui mekanisme Mixture-of-Experts, namun tetap mempelajari seluruh channel menggunakan satu model tanpa tahap pengelompokan berdasarkan hubungan statistik antarvariabel. Pada sistem sensor industri, channel sering kali merepresentasikan komponen fisik atau jenis pengukuran yang berbeda sehingga membentuk hubungan statistik yang beragam. Penelitian ini mengusulkan framework structure-aware decomposition, yang terdiri atas channel clustering berbasis korelasi Spearman dan hierarchical agglomerative clustering sebagai tahap pra-pemrosesan, diikuti pembelajaran beberapa instance HNAD yang dilatih secara independen pada masing-masing cluster. Framework dievaluasi melalui lima skema granularitas pada data getaran multisensor sistem pompa–motor industri (12 channel, empat lokasi sensor), serta divalidasi pada dataset publik SWaT. Hasil eksperimen multiseed (n=5) menunjukkan bahwa HNAD-Cluster menghasilkan mean squared error (MSE) yang signifikan lebih rendah dibandingkan HNAD-Global (penurunan 20,01%; p=0,00003), dengan perbaikan konsisten pada seluruh dua belas channel. Arah hasil serupa diperoleh pada SWaT (penurunan 37,83%). Pengelompokan berbasis korelasi statistik juga lebih unggul dibandingkan pengelompokan berdasarkan lokasi fisik pada dimensi input setara. Peningkatan performa terutama berasal dari dekomposisi struktural, sedangkan penambahan jumlah kelas laten tidak meningkatkan akurasi prediksi secara signifikan (p=0,339). Validasi menggunakan Normalized Mutual Information memperkuat temuan ini: pola regime temporal antar-channel dalam cluster yang sama lebih selaras dibandingkan channel lintas cluster (0,109 vs 0,033; p=0,000017). Namun, pada aspek deteksi anomali di SWaT, HNAD-Cluster justru lebih rendah dibandingkan HNAD-Global (AUC-PR 67,53?rbanding 79,74%). Temuan ini menunjukkan bahwa kualitas pemodelan normalitas dan kapasitas deteksi anomali dapat bergerak berlawanan arah sehingga perlu dievaluasi secara terpisah.
In industrial systems, anomalous data are often scarce and unlabeled. This condition motivates the use of normality modeling, which learns the characteristics of data under normal operating conditions and identifies deviations as anomalies. Deep learning methods for normality modeling in multivariate time series typically model all input variables with a single predictive model. Recent approaches such as HNAD addresses temporal heterogeneity using a Mixture-of-Experts mechanism, but still models all channels jointly without grouping based on statistical relationships. In industrial sensor systems, channels often represent different physical components or measurement types, resulting in diverse statistical relationships. This study proposes a structure-aware decomposition framework that combines Spearman correlation-based channel clustering and hierarchical agglomerative clustering as preprocessing stage, followed by independent HNAD instances for each cluster. The framework is evaluated using five granularity schemes on multisensor vibration data from an industrial pump–motor system (12 channels, four sensor locations) and validated on the public SWaT dataset. Multiseed experiments (n=5) show that HNAD-Cluster achieves significantly lower mean squared error (MSE) than HNAD-Global, with a 20.01% reduction (p=0.00003) across all twelve channels. A similar trend is observed on SWaT, with a reduction of 37.83%. Statistical correlation-based grouping also outperforms grouping based on physical location under an equivalent input dimension. The performance improvement primarily results from structural decomposition, whereas increasing the number of latent classes does not significantly improve prediction accuracy (p=0.339). Validation using Normalized Mutual Information further supports this finding: temporal regime patterns among channels within the same cluster are more aligned than those across different clusters (0.109 vs. 0.033; p=0.000017). However, in terms of anomaly detection on SWaT, HNAD-Cluster performs worse than HNAD-Global, with AUC-PR values of 67.53% and 79.74%, respectively. These results show that normality modeling and anomaly detection performance can diverge and should therefore be evaluated separately.
